Every AI application is fundamentally a problem of context. A language model without context hallucinates. A recommendation system without context suggests irrelevant results. A search engine without context returns noise. For the past two years, the industry has thrown the most obvious resource at this problem: more text. Retrieval-Augmented Generation (RAG) promised to fix the context window limits by stuffing relevant chunks into prompts. Vector databases became the default retrieval mechanism, relying on semantic similarity to pull paragraphs from a corpus.
This solved one dimension of context—semantic closeness—but almost entirely ignored another, more critical dimension: structural relatedness. A vector search can find you documents about a manager and a project, but it cannot tell an LLM that the manager directly manages that project, was assigned last March, and is currently overdue on a quarterly review. That is not a semantic association; it is a relational, temporal, and hierarchical fact. Retrieving it requires traversing a typed edge in a graph, not computing a cosine distance against an embedding.
This is why the industry is converging on a new architecture: GraphRAG. It is the single highest-velocity topic across the data and AI engineering landscape, and for good reason. Knowledge graphs do not replace vector databases; they solve the structural context gap that vectors leave open. They turn context from a static blob of text into a dynamic, queryable, auditable map of entities and their relationships. For senior engineers building production AI, context engineering is the new stack, and knowledge graphs are the relational backbone.
A knowledge graph models context as a first-class structure. An entity alone is a node. Context is the combination of the node, its typed relationships, the properties on those relationships, and the temporal bounds that define relevance.
Consider a fraud detection scenario. A single device ID connecting to a system is meaningless noise. In a knowledge graph, you run a query that extracts the context around that device:
// Extract the high-risk context for a specific device
MATCH (d:Device {device_id: "f59a2..." })-[:HAS_LOGIN]->(a:Account)
WITH d, count(a) AS account_count, collect(a.id) as accounts
MATCH (a:Account)-[t:TRANSFER]->(target:Account)
WHERE a.id IN accounts AND t.amount > 10000
RETURN d.install_date, account_count, target.id, t.amount, t.timestamp
A vector database storing documents about the device cannot yield this context. It can only retrieve paragraphs that mention the device ID. The graph, however, traverses a second-degree relationship—from device to associated accounts, and from those accounts to high-value transfers. This is not semantic closeness; it is relational proximity.
The output itself becomes the context for an AI agent, providing the precise chain of events that makes the device suspicious. It is less text, more truth.
The practical workflow for using a knowledge graph as a context source for an LLM involves three steps: entity extraction, graph traversal, and structured serialization.
Here is a concrete Python pattern that retrieves a contextual subgraph and formats it directly into an LLM prompt:
from neo4j import GraphDatabase
def graph_context_to_prompt(tx, entity_name: str, user_query: str, depth: int = 2) -> str:
"""
Retrieves the ego network of an entity and serializes it
as structured JSON for the LLM prompt.
"""
cypher = """
MATCH (n {name: $entity_name})-[r*1..$depth]-(m)
UNWIND r AS rels
RETURN n.name AS source, type(rels[0]) AS relation, m.name AS target,
properties(rels[0]) AS rel_properties
LIMIT 200
"""
results = tx.run(cypher, entity_name=entity_name, depth=depth).data()
import json
context_block = json.dumps(results, indent=2)
return f"""
# Structured Graph Context for '{entity_name}':
The following defines the entity's neighborhood within the knowledge graph:
{context_block}
# User Query:
{user_query}
# Instruction:
Ground your response in the structured context above. If the context provides a
direct relational path relevant to the query, state it explicitly. If the context
is insufficient, say so. Do not add external knowledge.
"""
This approach transforms the retrieval layer. Instead of injecting raw top-K chunks of text, you inject a structured map of typed relationships. The LLM receives explicit facts—Alice -[MANAGES]-> Project Echo—rather than a paragraph from which it must infer the management hierarchy. Serialized graph context reduces hallucination because the model no longer needs to guess the structure of the relationship; it is given explicitly.
Text documents are snapshots in time. A vector index against a corpus of static PDFs has no inherent concept of when a fact was true. Knowledge graphs, by contrast, allow temporal properties on both nodes and edges, enabling dynamic stateful context.
Consider an enterprise AI assistant building context around an employee's role history:
MATCH (p:Person {name: "Alice"})-[rel:HAS_ROLE]->(c:Company)
WHERE rel.start_date <= date("2023-06-01")
AND (rel.end_date IS NULL OR rel.end_date >= date("2023-06-01"))
RETURN c.name AS company, rel.role_title AS title, rel.start_date
Without this temporal graph query, an LLM could be given a prompt that incorrectly assumes Alice's current title applies retroactively. The graph provides temporal context: it answers not just "who is Alice?" but "who was Alice in June 2023?". For use cases like KYC audits, insurance claims investigation, or regulatory compliance, this temporal dimension to context is non-negotiable. Vector databases can approximate this with metadata filtering, but a property graph makes it a first-class, traversable dimension of the context itself.
The poster child for the failure of standard RAG is the multi-hop question. “What is the name of the manager of the engineer who fixed the bug in the payment module?” requires the model to traverse a chain of entities and relationships. A vector retrieval, no matter how good, retrieves chunks. It does not retrieve paths.
Graphs solve this by design.
MATCH (bug:Bug {status: "Fixed", component: "Payments"})-[:FIXED_BY]->(eng:Engineer)
MATCH (eng)-[:REPORTS_TO]->(mgr:Manager)
RETURN bug.title, eng.name AS engineer, mgr.name AS manager
When this path is serialized into the prompt, the LLM no longer needs to bridge the gap between the bug report and the organizational chart. The context is the path. The accuracy delta between a standard RAG system answering this query and a GraphRAG system is dramatic—often the difference between hallucination and a verifiable answer.
The most immediate and high-impact use case is the internal enterprise assistant. Employees ask assistants complex questions involving people, projects, skills, and organizational structures. “Find the engineer who worked on GraphQL integrations for the Data Platform team.” A vector DB retrieves resumes and project decks. A knowledge graph retrieves the exact engineer by traversing the graph from the Data Platform team, through its projects, and into the specific skill and code repository nodes. The graph provides organizational context that allows the AI to resolve the query without ambiguity.
In lending or clinical decision support, context is not just helpful—it is an audit requirement. “Why was this specific decision made?” The answer requires a traversable chain of data: the patient’s symptoms, the retrieved clinical trials, the drug interaction graph, and the physician’s override. A knowledge graph models this as a linked audit trail. An LLM augmented with graph context can provide explicit, referenced reasoning paths. This moves the AI from a black-box suggestion engine to a transparent decision support system, a requirement in regulated environments.
The race to contextualize AI is fundamentally a semantic engineering problem. Vector databases capture what is close in an embedding space. Knowledge graphs capture what is connected in a domain model. They are complementary, but for any use case requiring deep, multi-fact, temporal, or relational reasoning, the graph is the superior context primitive.
